    This work aims to train a recurrent neural network to generate signals that replicate the frequency characteristics of sleep EEG. The input to the network represents the current sleep stage of the EEG. For training, EEG data, including sleep-state transitions, are used as the target, and the loss function is defined as the difference between the power spectrum of the sleep EEG and the power spectrum of the output signal. This research may provide important clues to the dynamical mechanisms underlying the rhythmic activity of brain waves during sleep.

    The Variational Autoencoder (VAE) has demonstrated a strong ability to compress high-dimensional data with nonlinear structure into low-dimensional latent spaces. Recently, VAEs have been used to analyze high-dimensional and sparse gene expression data from single-cell RNA sequencing (scRNA-seq). However, the latent variables learned by VAEs are often difficult to interpret biologically, which makes it challenging to gain insights or generate hypotheses from the latent space. We propose integrating Mutual Information Neural Estimation (MINE) into the VAE framework to guide specific latent dimensions toward capturing known metadata, such as developmental time or cell type. Using mouse embryo scRNA-seq data, we demonstrate that MINE-guided latent variables exhibit strong correlations with pseudotime estimates and lead to better clustering results. These results indicate that mutual information constraints can enhance both the interpretability and utility of VAE-based representations for scRNAseq analysis.

    Functional differentiation is the process by which different brain areas become specialized for specific functions. Such differentiated structures can also emerge in artificial neural networks. Elucidating this process is crucial for understanding brain functions. Here, we propose a novel method that induces functionally differentiated structures in recurrent neural networks (RNNs) by minimizing mutual information between neural subgroups. The RNN was trained to separate two superimposed chaotic signals while the mutual information between subgroups was minimized through a minimax optimization framework. We analyzed the development of dynamical and anatomical modularity during learning and found that dynamical modularity emerged earlier and more prominently than anatomical modularity. Furthermore, we investigated the robustness of the differentiated network and found that functional specialization was accompanied by increased resistance to input noise, while the response to neuron damage exhibited qualitative changes of network dynamics. These findings suggest that mutual information minimization promotes both functional specialization and robustness.

    The hippocampus, a region of the brain, plays key roles in both spatial and episodic memory. In this study, we trained a recurrent neural network (RNN) to reproduce neural activity observed in rats performing an episodic memory task, aiming to generate activity patterns analogous to hippocampal place cells and episode-dependent cells. The RNN learned a task that required navigating a two-dimensional space based on current sensory input and selecting actions depending on past behavioral history. Our analysis revealed that a subset of neurons exhibited increased activity at specific spatial locations, resembling place fields. Another subset showed changes in firing activity depending on past choices, reflecting episode-dependent responses. Moreover, episode-dependent neurons displayed little spatial selectivity, whereas place cells encoded distinct spatial information, suggesting that functional differentiation emerged within the RNN.

    Abstract

    Functional differentiation in the brain emerges as distinct regions specialize and is key to understanding brain function as a complex system. Previous research has modeled this process using artificial neural networks with specific constraints. Here, we propose a novel approach that induces functional differentiation in recurrent neural networks by minimizing mutual information between neural subgroups via mutual information neural estimation. We apply our method to a 2-bit working memory task and a chaotic signal separation task involving Lorenz and Rössler time series. Analysis of network performance, correlation patterns, and weight matrices reveals that mutual information minimization yields high task performance alongside clear functional modularity and moderate structural modularity. Importantly, our results show that functional differentiation, which is measured through correlation structures, emerges earlier than structural modularity defined by synaptic weights. This suggests that functional specialization precedes and probably drives structural reorganization within developing neural networks. Our findings provide new insights into how information-theoretic principles may govern the emergence of specialized functions and modular structures during artificial and biological brain development.

    海馬CA1野錐体細胞に対し、2つの独立経路から時空間的にランダムな電気刺激を行った際の膜電位応答を記録した。その結果、応答は、刺激のパターンや以前の刺激パターンによってクラスター化されていた。そのクラスター化の度合いは、刺激の強度に依存しており、閾値下の弱い刺激による応答に比べ閾値上の強い刺激による応答の方が、より以前のクラスターのパターンを内包していた。このクラスター化は、海馬の神経情報処理モデルとして、津田らによって提案されているカントールコーディングモデルに必要な条件の一つである。本研究の結果は、海馬CA1野錐体細胞において、カントールコーディングが行われている可能性を示すものである。
